IBM Research Explains How Distributed Inference Coordinates Large AI Models

IBM Research details six key mechanisms—including prefix-cache-aware routing and KV-cache offloading—that enable distributed systems to efficiently serve large language models and handle bursty agentic traffic.

Serving large language models at scale involves more than just running a model on a GPU; it requires coordinating thousands or millions of requests with varying priorities and context lengths. IBM Research explains this challenge using an air traffic control analogy: just as controllers manage aircraft location, destination, and fuel needs, distributed inference frameworks must optimize accelerator usage without creating long queues or redundant computations.

The core of this coordination lies in working above individual model servers like vLLM or SGLang. A distributed inference framework orchestrates groups of servers across a cluster, considering queue depth, cache availability, and server roles to route requests effectively. This layer becomes increasingly necessary as AI agents introduce irregular traffic patterns, such as bursts of related requests followed by pauses for tool calls.

One critical innovation is prefix-cache-aware routing. When a model processes a prompt, it stores intermediate states in a KV cache. If subsequent requests share the same beginning text—common in chatbots with fixed system instructions or coding assistants examining the same repository—the model can reuse this stored computation. Conventional load balancers might send these requests to any available server, forcing redundant processing. Prefix-aware routing instead directs requests to servers that already hold the relevant context, reducing latency and increasing throughput.

To support this reuse, KV-cache offloading extends the model's working memory. Accelerator memory is fast but limited, often filled by long prompts and concurrent sessions. Offloading moves less immediately useful cache entries to slower but larger tiers like CPU memory or local storage. While retrieval from these tiers is slower than from accelerator memory, it is significantly faster and cheaper than recomputing the entire prompt, thereby expanding effective cache capacity.

Flow control manages admission and ordering of requests under load. Without it, latency-sensitive interactive queries could get stuck behind lower-priority batch jobs. Distributed inference systems enforce fairness and priority, protecting interactive traffic while pacing bursty or deferrable work. This discipline is essential for absorbing the uneven nature of agentic traffic, smoothing bursts into orderly streams.

Batch inference optimization fills spare capacity without clogging the system. Background tasks like research evaluations or document processing can utilize idle hardware resources. However, they must be managed carefully to avoid delaying user-facing responses. Systems separate job management from request placement, allowing batch layers to determine how work enters the system while routers decide where each request runs, ensuring shared infrastructure remains responsive.

Prefill/decode disaggregation separates two distinct computational phases. Prefill processes the input prompt and builds the KV cache, requiring high parallel computation. Decode generates the response token by token, being sensitive to memory access delays. By assigning these phases to specialized workers that scale independently, operators can add resources where pressure exists—more prefill capacity for long documents, more decode capacity for active conversations—reducing interference between dissimilar workloads.

Wide expert parallelism addresses the memory constraints of Mixture-of-Experts (MoE) models. These models contain many specialized neural networks, or experts, but only a subset is activated per token. Traditional tensor parallelism divides operations across GPUs, requiring frequent synchronization. Wide expert parallelism distributes experts across GPUs and servers, sending tokens only to the GPUs holding selected experts. This sparse communication frees up accelerator memory for the KV cache, enabling the serving of extremely large MoE models.

Together, these mechanisms transform LLM serving from isolated servers into a coordinated distributed system. As AI moves beyond simple chat toward agents maintaining long contexts and generating irregular traffic, performance depends on this coordination rather than just raw capacity. Adding more accelerators does not automatically make inference fast or affordable; the system must know where work should go, what can be reused, and which resources suit each stage.
